I. Tổng quan về ứng dụng học sâu dự báo chuỗi thời gian doanh số

Học sâu đang cách mạng hóa dự báo doanh số bằng cách xử lý khối lượng dữ liệu lớn và phát hiện các mẫu phi tuyến phức tạp. Mô hình học sâu vượt trội so với phương pháp thống kê truyền thống nhờ khả năng học biểu diễn đặc trưng tự động từ dữ liệu thô. Trong nghiên cứu này, các mô hình LSTM, GRU và TCN được triển khai để dự báo doanh số dựa trên dữ liệu thời gian. 1.1. Vai trò của dự báo doanh số trong quản trị doanh nghiệp

Dự báo doanh số là yếu tố quyết định trong quản trị doanh nghiệp, ảnh hưởng trực tiếp đến hoạch định tài nguyên, quản lý tồn kho và chiến lược tiếp thị. Theo nghiên cứu của McKinsey (2023), doanh nghiệp sử dụng dự báo chính xác có thể giảm 20% chi phí tồn kho và tăng 15% doanh thu nhờ tối ưu hóa sản xuất. Đối với ngành bán lẻ, dự báo doanh số giúp điều chỉnh nguồn cung theo nhu cầu theo mùa, đặc biệt trong các dịp lễ hội. Sự ra đời của học sâu đã nâng cao độ chính xác dự báo từ 70% (phương pháp truyền thống) lên 90% thông qua mô hình hóa các yếu tố phức tạp.

1.2. Thách thức trong dự báo chuỗi thời gian doanh số

Dự báo doanh số gặp thách thức từ tính phi tuyến, biến động theo mùa và nhiễu dữ liệu. Các yếu tố ngoại sinh như sự kiện khuyến mại, biến động kinh tế vĩ mô và hành vi người tiêu dùng làm tăng độ khó dự báo. Phương pháp thống kê truyền thống như ARIMA thường thất bại trước những biến động đột ngột. Ngoài ra, dữ liệu thiếu hụt hoặc không đồng nhất cũng cản trở hiệu suất mô hình. Theo khảo sát Gartner (2024), 65% doanh nghiệp báo cáo sai lệch dự báo trên 20% do không xử lý được yếu tố ngoại sinh.

II. Phân tích các phương pháp dự báo doanh số hiện nay

Phương pháp thống kê truyền thống như ARIMA, SARIMA và Holt-Winters từng là tiêu chuẩn trong dự báo doanh số nhờ đơn giản và dễ triển khai. ARIMA phù hợp với dữ liệu không có yếu tố mùa, trong khi SARIMA xử lý tốt dữ liệu có tính mùa vụ. Tuy nhiên, những phương pháp này giới hạn bởi giả định tuyến tính và không thể nắm bắt các mẫu phi tuyến phức tạp. Mặt khác, học sâu sử dụng mạng nơ-ron nhân tạo để học biểu diễn đặc trưng từ dữ liệu thô. LSTM giải quyết vấn đề mất mát gradient trong dữ liệu dài hạn, trong khi GRU cung cấp sự cân bằng giữa hiệu suất và chi phí tính toán. TCN kết hợp ưu điểm của mạng tích chập với khả năng xử lý chuỗi thời gian.

2.1. Hạn chế của mô hình thống kê truyền thống

Mô hình thống kê truyền thống yêu cầu dữ liệu phải tuân theo các giả định nghiêm ngặt như tính dừng, không có yếu tố ngoại sinh. ARIMA không thể xử lý dữ liệu thiếu hụt hoặc biến động đột ngột. SARIMA cải thiện bằng cách bổ sung yếu tố mùa vụ nhưng vẫn giới hạn bởi khả năng mô hình hóa các mối quan hệ phi tuyến. Holt-Winters hiệu quả với dữ liệu có xu hướng tuyến tính nhưng thất bại trước các điểm bất thường. Theo nghiên cứu của Hyndman (2022), ARIMA chỉ đạt độ chính xác 65% trên dữ liệu doanh số bán lẻ có yếu tố khuyến mại.

2.2. Ưu điểm của học sâu trong dự báo doanh số

Học sâu vượt trội nhờ khả năng học biểu diễn đặc trưng tự động từ dữ liệu thô. LSTM ghi nhớ thông tin dài hạn thông qua cơ chế cửa kiểm soát, giải quyết vấn đề mất mát gradient. GRU đơn giản hóa kiến trúc nhưng vẫn duy trì hiệu suất cạnh tranh. TCN kết hợp mạng tích chập với lớp bỏ qua, cho phép xử lý song song và nắm bắt mẫu cục bộ. Theo báo cáo của IBM (2023), học sâu giảm 40% sai số dự báo so với phương pháp truyền thống trong ngành bán lẻ.

III. Phương pháp luận nghiên cứu ứng dụng học sâu

Nghiên cứu triển khai ba mô hình học sâu: LSTM, GRU và TCN để dự báo doanh số dựa trên dữ liệu thời gian. Dữ liệu được thu thập từ Kaggle, bao gồm doanh số bán lẻ trong 3 năm với các yếu tố ngoại sinh như ngày lễ, khuyến mại. Quá trình tiền xử lý bao gồm chuẩn hóa MinMax, tạo cửa sổ trượt 7 ngày để nắm bắt chu kỳ tuần. Dữ liệu được chia theo thời gian 80% huấn luyện, 20% kiểm tra để tránh nhiễu dữ liệu. Các mô hình được đánh giá bằng chỉ số MAE, RMSE và SMAPE. Kết quả cho thấy TCN đạt độ chính xác cao nhất, tiếp theo là LSTM và GRU.

3.1. Quá trình tiền xử lý dữ liệu

Dữ liệu doanh số được tiền xử lý bằng cách chuẩn hóa MinMax để đưa tất cả biến về khoảng [0,1], ngăn chặn tình trạng thống trị bởi biến có giá trị lớn. Cửa sổ trượt 7 ngày tạo ra các mẫu đầu vào X[i] = data[i:i+7] và đầu ra y[i] = data[i+7]. Dữ liệu được chia theo thời gian 80-20% để duy trì tính toàn vẹn thời gian. Biến ngoại sinh như 'is_holiday' được bổ sung để nắm bắt nhu cầu tăng cao vào cuối tuần. Kỹ thuật này đảm bảo mô hình học được các mẫu có ý nghĩa mà không bị nhiễu dữ liệu.

3.2. Đánh giá hiệu suất mô hình

Hiệu suất mô hình được đánh giá bằng ba chỉ số: MAE đo độ lệch tuyệt đối trung bình, RMSE đo sai số bình phương trung bình, SMAPE đo sai số phần trăm đối xứng. TCN đạt MAE thấp nhất 12.3, tiếp theo là LSTM 14.5 và GRU 15.2. So với SARIMA (MAE 22.1), học sâu giảm sai số tới 44%. Kết quả khẳng định ưu thế của học sâu trong dự báo doanh số, đặc biệt với dữ liệu có yếu tố mùa vụ và biến động cao.

IV. Kết luận và khuyến nghị triển khai thực tế

Nghiên cứu chứng minh học sâu vượt trội so với phương pháp thống kê truyền thống trong dự báo doanh số. TCN đạt độ chính xác cao nhất nhờ khả năng xử lý song song và nắm bắt mẫu cục bộ. Kết quả này cung cấp cơ sở khoa học để doanh nghiệp ứng dụng học sâu trong hoạch định kinh doanh. Đề xuất triển khai mô hình TCN cho doanh nghiệp bán lẻ do khả năng thích ứng cao với biến động thị trường. Nghiên cứu cũng khuyến nghị kết hợp dữ liệu ngoại sinh để nâng cao độ chính xác dự báo. Việc áp dụng học sâu sẽ giúp doanh nghiệp giảm chi phí tồn kho và tối ưu hóa sản xuất.

4.1. Đề xuất mô hình tối ưu cho doanh nghiệp

TCN là lựa chọn tối ưu cho doanh nghiệp nhờ khả năng xử lý song song và hiệu suất tính toán cao. Mô hình này phù hợp với dữ liệu doanh số có yếu tố mùa vụ và biến động cao. Doanh nghiệp nên triển khai mô hình này trong hệ thống hoạch định nguồn lực (ERP) để dự báo doanh số theo thời gian thực. Việc kết hợp TCN với dữ liệu ngoại sinh như ngày lễ, khuyến mại sẽ nâng cao độ chính xác dự báo lên tới 90%. Đây là giải pháp tiết kiệm chi phí so với phương pháp truyền thống.

4.2. Hướng nghiên cứu tương lai

Hướng nghiên cứu tiếp theo nên tập trung vào tích hợp dữ liệu đa nguồn như cảm biến IoT, mạng xã hội để nâng cao độ chính xác. Việc kết hợp học sâu với học máy truyền thống có thể tạo ra mô hình lai hiệu quả. Nghiên cứu cũng khuyến nghị thử nghiệm các kiến trúc mới như Transformer trong dự báo doanh số. Ngoài ra, việc áp dụng học sâu vào dự báo doanh thu theo sản phẩm cụ thể sẽ mang lại giá trị thực tiễn cao cho doanh nghiệp.

Using actual sales data obtained from a publicly available dataset on Kaggle, the research applies multiple forecasting techniques to examine their accuracy and effectiveness. In addition to traditional statistical models such as Autoregressive Integrated Moving Average (ARIMA), Seasonal Autoregressive Integrated Moving Average (SARIMA), and Holt-Winters Exponential Smoothing, the study implements deep learning models including Long Short-Term Memory (LSTM), Gated Recurrent Unit (GRU), and Temporal Convolutional Network (TCN). The performance of all models is assessed using error metrics such as Mean Absolute Error (MAE), Root Mean Squared Error (RMSE) and Symmetric Mean Absolute Percentage Error (SMAPE).

Results indicate that deep learning models, particularly TCN, LSTM, and GRU, outperform traditional methods in terms of forecasting accuracy. Based on these findings, the study provides recommendations for using deep learning to improve sales forecasting and business decision-making. INTRODUCTION TO THE RESEARCH TOPIC 1. Statement of the research problem In the context of an increasingly volatile global economy and intensifying market competition, accurate forecasting of sales significantly contributes to the effectiveness of retail business by utilizing data and analytical methods to predict future sales performance. It serves as a critical decision-making tool that supports various departments, including inventory management by avoiding overproduction and reducing overstock (Islam & Amin, 2020; H. Nguyen et al., 2021), as well as marketing strategies and workforce planning.

Additionally, it can be helpful in increasing the profitability of a company by cost prediction (Huang et al., 2019; Islam et al., 2021; Sohrabpour et al., 2021; Verstraete et al. Inaccurate forecasts may lead to significant losses with overstocking, missed sales opportunities and poorly managed resources all affecting a company’s bottom line. Sales forecasting involves estimating future sales based on historical data, market trends and other relevant factors. It focuses on predicting the quantity of products or services a company is likely to sell over a specific period, such as weeks, months, or years.

This process leverages quantitative and qualitative methods to generate insights that help companies prepare for future demand (Isreal & Alonge, n. Identifying major factors that influence future sales can be done by analyzing sales patterns, whether of total store sales or specific products. It is important to note that forecasting difficulty varies across products. Some products, like milk, have stable consumption patterns and are easier to forecast (Choprar & Meindl, 2001; Padilla et al., 2021), while products like fashion items or furniture are influenced by trends and seasonality, making prediction more challenging.

Among the common techniques for sales forecasting is time series analysis, particularly in environments with clear seasonal or cyclical demand. By examining data points gathered over time such as monthly or quarterly sales, businesses can identify trends, seasonality, and long-term demand shifts (MAGRINI, 2023). Traditional forecasting models such as the Autoregressive Integrated Moving Average (ARIMA) model have been widely adopted due to their ability to capture recurring patterns in time series data (G. Box et al.

Similarly, exponential smoothing methods, including the Holt-Winters seasonal model, have proven effective 2 for seasonally adjusted forecasts (Hyndman & Athanasopoulos, 2018). These models tend to perform well in environments characterized by stability and predictability. However, these methods often rely on strong assumptions of linearity and stationarity, making them less effective when dealing with nonlinear patterns, noise or long-term dependencies in the majority of time series data today. In recent years, deep learning (DL) techniques, a subset of machine learning (ML), have outperformed traditional ML approaches across numerous tasks, driven by several critical advancements (Han et al.

These techniques have also been applied to time series forecasting, as they can handle complex and high-dimensional time series that are typically beyond the capabilities of traditional machine learning methods (Casolaro et al. DL models like Long Short-Term Memory (LSTM), Gated Recurrent Units (GRU), and Temporal Convolutional Networks (TCN) are capable of learning complex temporal dependencies without the need for extensive manual feature engineering or strong assumptions about the data structure. However, detailed investigations into the application of deep learning models in sales time series forecasting remain relatively scarce, especially in the context of emerging markets and practical business data. The number of empirical studies focusing specifically on evaluating and comparing these models for sales forecasting tasks is still limited.

General objective The primary objective of this study is to investigate the application of deep learning models in sales time series forecasting and evaluate their effectiveness compared to traditional statistical methods. Specific objective - Select and implement deep learning models such as Long Short-Term Memory (LSTM), Gated Recurrent Units (GRU), and Temporal Convolutional Networks (TCN) for sales time series forecasting. - Apply deep learning models to actual sales datasets, specifically those obtained from publicly available sources such as Kaggle. - Compare the forecasting performance of deep learning models with traditional statistical methods.

3 - Compare the strengths and limitations of traditional and deep learning models in handling real-world sales data challenges. - Provide practical recommendations for businesses in optimizing sales forecasting and inventory management based on the study findings.
